## Why I went down this rabbit hole

I was building a tiny “multi-robot relay” prototype for edge inference: one robot captures sensor data, an edge server runs the model, and another robot needs to act on the result with very tight timing. The annoying part wasn’t the model—it was *handover timing*.

On real 5G/6G deployments, handovers and scheduling can introduce jitter (random small timing shifts). For most apps that’s fine, but for “capture → transmit → infer → respond” loops, jitter can become the difference between stable behavior and oscillation.

So I tried a very specific trick: **a deterministic timing beacon sent using an Ultra-Reliable Low-Latency Communications (URLLC)-like periodic pattern**, then using that beacon to align handovers and inference windows across robots. The beacon itself isn’t magic; it’s just a timestamp reference that keeps every participant “speaking the same time language.”

Below is what I built and the code I used to simulate the mechanism.

## The niche idea: “Edge Inference Windows” anchored to Timing Beacons

**Timing beacon**: a periodic message (think: “tick-tick-tick”) that carries a reference timestamp `t0`.

**Inference window**: a fixed time slot where the system is allowed to accept a specific sensor sample and produce an output.

My goal: when a robot switches networks (handover), it may experience delays, but the **beacon alignment** lets the edge server:
- map incoming sensor samples to the correct inference window, and
- decide whether to accept/reject a sample based on timing tolerance.

That turns handover jitter into a manageable “late/early sample” problem rather than a chaotic one.

## What I implemented (in code): a beacon sender + edge receiver + robotic handover simulator

I built everything as a local simulation so I could reason about timing behavior. The key components:

1. **Beacon server**
   - broadcasts beacon messages with a timestamp
   - sends them at a fixed period (e.g. every 50 ms)

2. **Robot simulator**
   - generates “sensor frames” with timestamps
   - simulates handovers by injecting random network delay and sometimes dropping frames
   - reports the frame to the edge along with an observed receive time

3. **Edge inference scheduler**
   - computes which inference window a frame belongs to based on the last known beacon
   - accepts frames that land in-bounds
   - runs a dummy inference (so the timing pipeline is the focus)
   - returns an “action time” that the next robot could use

### What matters here
- `period_s` is the “tick rate.” I used **50ms** for clarity.
- Every beacon carries `seq` and `t0`. The edge uses these to anchor inference windows.
- In production, you’d align to a standardized time source (network time synchronization). In the sim, I use `time.time()`.

## Step 2: Edge scheduler + inference acceptance logic

This is where the deterministic behavior happens.

### Definitions I used
- **Inference window** width: `window_s` (e.g. 20ms)
- Each frame has a `frame_time_s` (when it was captured) and an `arrival_time_s` (when the edge receives it).
- The scheduler estimates the *time index* (which window number) relative to the last beacon.

### Why this works (and what I observed)
- The beacon provides a *stable reference* (`last_beacon_t0`).
- The inference window index is derived deterministically from the frame’s capture time.
- If handover jitter delays arrival too long, the frame becomes “late,” and the edge rejects it rather than feeding stale data into the control loop.

That makes system behavior more predictable under network transitions.

Using 5G Urllc Timing Beacons For Deterministic Multi-Robot Handovers With Edge Inference

## The problem I tripped over: “Edge AI feels fast… until it isn’t”
I built a small “physical AI” prototype for edge inference: a camera produced frames, an on-site box ran a model, and the output triggered a motion controller. Everything *worked*—but the control loop occasionally jittered by a few hundred milliseconds. It didn’t look like a CPU issue; it looked like time.

My suspicion was simple: without a shared time reference across the 5G transport, the edge application, and the hardware that consumes the inference results, “real-time” becomes “eventually consistent.”

So I went digging into an oddly specific corner of the stack: **aligning 5G transport timing to edge compute using a time-aware networking path (TSN) and verifying it with P4Runtime**. This post documents what I did and why it fixed the jitter.

## What I built (high level)
- **Open5GS** (5G core + access) to create a user plane path
- A Linux-based edge node that:
  - receives sensor packets
  - runs inference
  - stamps results with a **monotonic** timestamp
- A **TSN-like time-gated pipeline** (implemented via Linux traffic control) to reduce scheduling variance
- A **P4Runtime** program that measures per-packet latency and correlates it with gate windows

Even though the whole system spans networking + edge compute + robotics-style control timing, the key idea was:  
**make packet delivery and processing happen inside predictable time windows, and prove it with packet-level telemetry.**

## The niche trick: use time-gated queues keyed by a network timestamp
I used a pragmatic “TSN-inspired” approach:

1. Each incoming sensor packet carries:
   - a `t_net_ns` timestamp (nanoseconds) generated at the ingress (near the radio-facing side)
2. On the edge, I compute:
   - `delta = t_now - t_net_ns`
3. I enforce that packets only traverse the “low jitter” queue during a configured gate window.

This doesn’t magically create true TSN hardware across every link, but it made the pipeline dramatically more deterministic in my lab environment.

## Step 1: Generate test packets with a network timestamp
For the lab, I needed deterministic traffic. I used a tiny Python UDP sender that stamps each packet with the current time in nanoseconds since boot.

### Why `monotonic_ns()`?
The real-world issue is clock discontinuities. `time.time()` can jump if the system clock adjusts. `time.monotonic_ns()` is monotonic, so it stays consistent for measuring “how late” something arrived.

## Step 2: Receive packets and compute edge delay
Next I wrote a UDP receiver that:
- extracts `t_net_ns`
- computes `delta_ns`
- runs a dummy “inference” workload
- prints the measured delay

### What I learned immediately
Before any gating, the `delta_ms` output had occasional spikes—exactly the kind of tail latency that makes control loops stumble.

## Step 3: Add a time-gated queue with Linux traffic control
Linux doesn’t ship a full TSN stack out of the box, but you can implement **time-aware behavior** using queueing disciplines and scheduling primitives.

I used:
- `tc` with HTB class hierarchy for prioritization
- a gating-like behavior by controlling when traffic is allowed through a lower-jitter queue

This is the part that felt the most “random internet blog” at first—until I made it concrete: I configured two bands:
- a **high-priority gate band** for the next small time window
- a **default band** otherwise

### The “gate daemon” that flips which class matches
The TSN concept is “only forward during a scheduled gate.” I emulated it by toggling a filter quickly in a loop.

### How this connects to 5G/6G integration
In a 5G user-plane scenario, the path between the radio and the edge can introduce microbursts. By enforcing a predictable queueing schedule near the edge, I reduced the variance that bubbled into inference completion times.

## Step 4: Add packet latency telemetry with P4Runtime
To make the behavior measurable, I used P4Runtime to report per-packet egress timestamp differences. The concept:

- mark a packet at ingress (ingress pipeline metadata)
- compute latency at egress by subtracting timestamps
- export to the control plane over gRPC (P4Runtime)

#### Important note (what I actually did in the lab)
Different P4 targets expose timestamps differently. In practice, I used a target setup where:
- the switch can provide a timestamp intrinsic (or it can be approximated with pipeline events)
- the control plane correlates the measurements with the edge app logs

Because the exact timestamp intrinsic varies by P4 target, I focused on the working integration pattern: **export per-packet telemetry to userspace, correlate with edge inference logs, and look at tail latency**.

## How this maps to a real robot pipeline

In my implementation on actual hardware, the “signals” came from:

- **Camera signature**  
  For each frame:
  - take a small ROI in the lower-middle of the image (often where ground-plane features are)

## Practical gotchas I hit (and fixed)

### 1) “Timestamped” doesn’t mean “clock-aligned”
My sensors were timestamped, but not on the same clock source (or not with consistent buffering assumptions). Cross-correlation turned that into a solvable calibration problem.

### 2) Correlation needs enough motion energy
If the robot stays still or moves extremely smoothly, signals become too flat and the peak is ambiguous. In practice:

# Edge Vision for Predicting Conveyor Belt Tear Using Tiny YOLOv8 and IMU Correlation

A couple weekends ago I got pulled into a frustrating smart-manufacturing problem: a conveyor belt would start “micro-tearing” along the same seam line, and by the time operators noticed, it was usually already expensive. The sensors on the line were telling *something* was wrong, but not *what*.

So I built a small edge pipeline that watches a single belt region with an on-device camera model and cross-checks it with an IMU (accelerometer/gyroscope) mounted near the motor. The goal was very specific: detect early tear artifacts in the image **and** correlate them with vibration patterns that happen when the belt starts slipping or deforming.

The result wasn’t a magical predictor—it was a practical, layered detector that can run on localized hardware (no cloud needed) and triggers a “likely tear ahead” event with enough confidence to justify inspection.

## What I built (and why it worked)

I used:

- **Tiny YOLOv8**: A lightweight object detection model. “Object detection” means the model outputs bounding boxes and class labels for features it learned during training.
- **IMU vibration features**: From accelerometer/gyro streams, I computed simple metrics like RMS vibration and dominant frequency energy.
- **Correlation logic**: I combined “tear probability from vision” with “vibration signature from IMU” to reduce false positives (dust, lighting changes, random marks).

The niche part: I focused on a *very narrow* seam region of the belt and trained the model to detect **tear edge micro-features** (thin bright/dark fringes) rather than generic “damage.” That made the detector sensitive to the real failure mode.

## Hardware assumptions

This example is written to be portable, but I designed the flow around a typical edge setup:

- A camera pointed at the belt seam region
- An IMU on the conveyor motor frame streaming at a few hundred Hz
- An edge device running Python (Raspberry Pi class, Jetson class, or industrial PC)

For the code below, I simulated camera frames and IMU data so the pipeline is runnable anywhere.

## Step 1: Define the event scoring rules

My scoring strategy was intentionally simple:

1. Vision model outputs a `tear_prob` between 0 and 1.
2. IMU features produce a `vibration_score` between 0 and 1.
3. I compute:

### Why these choices?
- RMS alone detects “more motion,” but conveyors always vibrate.  
- Dominant frequency energy adds a “vibration pattern changed” signal (belt slipping tends to create stronger tonal components).
- Persistence prevents a single good/bad frame from triggering.

## Step 2: Build a tiny end-to-end demo pipeline (simulated)

To make this blog post runnable, I simulate:
- Camera frames that sometimes contain a “tear” region
- IMU streams that correlate with that event

In production you’d replace the simulation with:
- a camera grab loop
- an IMU reader (serial, CAN, Ethernet, GPIO-based IMU module, etc.)
- a real YOLOv8 model inference

### What you should see
- Before step ~25, `tear_prob` stays low and `vib_score` stays low → `final` rarely exceeds the threshold.
- During step ~25–45, both vision and vibration spike → `TRIGGER=True` becomes frequent due to the persistence gate.
- After step ~45, values drop and triggers stop.

This confirms the *behavioral logic* even without the real model.

## Step 3: Swap in real Tiny YOLOv8 inference (real code scaffold)

### Why ROI matters so much
I trained and inferred on a **small ROI** around the seam because:
- tiny tear artifacts occupy only a few pixels
- background (rollers, shadows, labels) otherwise swamps the model
- inference becomes faster (less pixels to process)

## Step 5: Practical training notes from my seam-focused dataset

This is where I learned the most:

- **Labeling tiny micro-tear artifacts** is hard—small errors in bounding boxes change what the detector learns.
- I tightened the labeling scope to a seam ROI *and* trained only one class: `micro_tear_edge`.
- For data, I deliberately included:
  - dust/scratches that *look similar* but don’t progress into tears
  - lighting variations (industrial lights flicker sometimes)
  - healthy belts with “scuff” marks

That’s how the correlation got its job done: vision gives a “this looks like the tear pattern” probability, IMU confirms “the belt dynamics changed.”

For each sample:

#### What I observed when running it
At first, `avg_heat` stays low and `alarm=False`. When the simulator injects a microstall, the next few samples ramp up the window average, and the script flips to `alarm=True` quickly. The “few samples delay” is intentional: averaging reduces false alarms from noise.

In a real setup, you’d replace `simulated_modbus_read()` with actual Modbus calls. The alarm logic stays the same.

If your machine exposes:

### One tiny improvement I learned the hard way: don’t average forever

I initially used a larger window, and alerts came too late. Microstalls are short and frequent in some processes, so I switched to a modest window (`window_size=30` at 200ms polling = ~6 seconds of context). That gave me:
- fast enough detection
- stable enough readings to ignore small fluctuations
